AI Predictive Defect Analysis: Reducing Batch Rejections in Manufacturing

We built an AI predictive defect analysis platform for Bodal Chemicals that unifies process, laboratory, and batch data to predict quality defects before a batch is complete. Real-time alerts and root-cause insights helped teams detect potential issues earlier, reducing batch rejections and rework.

Client Overview

Bodal Chemicals is an Ahmedabad-based, vertically integrated manufacturer of dyestuffs, dye intermediates, and basic chemicals. It operates multiple plants across Gujarat and supplies the textile, leather, and paper industries, with a strong export presence. Its products require consistent shade, strength, and purity to meet customer quality standards.

As production operations grew, manual quality checks conducted after batch completion made it difficult to identify defects early. Bodal Chemicals needed an AI predictive defect analysis solution to connect process, laboratory, and batch data, identify potential quality issues during production, and reduce rework and batch rejections.

Project Summary: The client faced delays in identifying quality defects because issues were often discovered only during final quality control (QC), after significant production resources had been used. Disconnected process, laboratory, and batch data also made root-cause analysis time-consuming. We built an AI predictive defect analysis platform that unifies process parameters, lab results, and batch records through a centralized quality data layer. XGBoost models analyze production data to predict potential defects before batches are complete. Power BI dashboards provide plant and quality teams with alerts, contributing factors, and insights to support root-cause investigation.

Project Challenges

The first challenge was that quality defects were often identified only during final inspection. Bodal Chemicals relied heavily on manual quality checks conducted after batch completion. Although sampling helped identify quality issues, it could miss process variations that developed during production. By the time a defect was confirmed, the batch had already consumed raw materials, energy, and production time. Approximately one in nine batches required rework or reprocessing, increasing production costs and reducing efficiency.

Another challenge was disconnected production and quality data. Temperature, pH, chemical dosing, reaction time, laboratory results, and batch records were stored separately. Quality teams had to correlate this information manually to identify the cause of a defect, which took about three days per incident. Addressing this required a structured approach to AI integration and connecting data across systems.

The third challenge was product and plant variability. Bodal Chemicals manufactured multiple product grades, each with specific requirements for shade consistency, strength, and purity. Differences in operating conditions and shift-to-shift practices made it difficult to establish a consistent quality baseline across plants. The solution needed to account for these variations without relying on a single set of thresholds for every product.

The team also needed a practical way to move from predictive insights to production use. Following an AI development life cycle approach would help structure model development, validation, deployment, and ongoing improvement while supporting adoption by plant operators and quality teams.

Solutions and Impact

We built a unified quality data layer that combines process parameters, laboratory results, and ERP batch records, linking them by batch ID and product grade. This gave Bodal Chemicals a consistent view of production conditions and quality results.

Using XGBoost models trained on historical batch data, we implemented AI predictive defect analysis to identify potential shade deviations, strength variations, and impurity issues while production was still running. Model explainability highlighted the parameters contributing to each predicted risk, helping teams investigate quality issues.

The platform alerted operators and supervisors to potential quality deviations and highlighted suggested responses, such as reviewing temperature, chemical dosing, or hold time. Operators could assess these insights before making process adjustments.

We also developed role-based Power BI dashboards to monitor quality trends, batch risks, and model predictions. Operator feedback helped identify prediction gaps and inform model retraining as new batch data became available. After a pilot at one plant, we refined the solution using operational feedback and rolled it out across three plants over six months. Our machine learning development services can help manufacturers turn operational data into predictive insights, improve quality control, and make informed production decisions.
